CCVR (Classifier Calibration with Virtual Representations for Federated Learning)
Algorithms AIMech:CcvrClassifierCalibrationWithVirtualRepresentationsForFederatedLearning DRAFT
Aliases: CCVR, Classifier Calibration with Virtual Representations, CCVR Federated Classifier Calibration
A post-training server-side classifier calibration algorithm for non-IID federated learning (Luo et al. 2021, Section 4, Algorithm 1, Equations 2-4) that freezes the federatedly trained feature extractor f_theta, collects each client k's per-class sample count N_{c,k}, sample feature mean mu_{c,k}, and Bessel-corrected sample covariance Sigma_{c,k} in a single privacy-preserving upload, reconstructs the exact pooled global Gaussian Mixture Model parameters mu_c = sum_{k=1}^K (N_{c,k}/N_c) mu_{c,k} and Sigma_c = sum_{k=1}^K ((N_{c,k}-1)/(N_c-1)) Sigma_{c,k} + sum_{k=1}^K (N_{c,k}/(N_c-1)) (mu_{c,k} - mu_c)(mu_{c,k} - mu_c)^T, draws virtual representations z_tilde ~ N(mu_c, Sigma_c), and retrains the linear classifier head g_varphi on the server.
Identity Notes & Concept Scope
Distinct from FedRep (AIMech:FedRepExploitingSharedRepresentationsForPersonalizedFederatedLearning, Collins et al. 2021), which learns client-specific personalized heads locally during alternating minimization rather than calibrating a single global classifier on the server via exact federated Gaussian mixture covariance reconstruction, and from FedDF (AIMech:FedDfEnsembleDistillationForRobustModelFusionInFederatedLearning, Lin et al. 2020), which requires an external unlabeled proxy dataset on the server for logit knowledge distillation.
Claims & Grounded Evidence
4 Claims
Mechanism
#r437-layer-wise-cka-diagnosis-of-classifier-bias-under-non-iid-data
Using linear Centered Kernel Alignment (CKA, Eq. 1) across client layers and per-class L_2 weight norms of the final linear classifier, Section 3 demonstrates that deeper layers — and above all the linear classifier head — exhibit the lowest cross-client representation similarity and strongest bias toward client majority classes, explaining why post-hoc calibration of the classifier head alone yields larger accuracy gains than regularizing the entire network.
Mechanism
#r437-exact-federated-gmm-mean-and-pooled-covariance-reconstruction
Without transmitting any individual client feature vectors z_{c,k,j}, the server identity Sigma_c = sum_{k=1}^K ((N_{c,k}-1)/(N_c-1)) Sigma_{c,k} + sum_{k=1}^K (N_{c,k}/(N_c-1)) (mu_{c,k} - mu_c)(mu_{c,k} - mu_c)^T (Eq. 3) reconstructs the exact centralized pooled sample covariance matrix over all N_c = sum_{k=1}^K N_{c,k} samples of class c, enabling plug-and-play calibration on top of FedAvg, FedProx, FedAvgM, and MOON (Section 4, Table 2).
Limitation
#r437-feature-dimension-quadratic-covariance-upload-and-gaussianity-limitation
Requires uploading C covariance matrices of size d x d (O(C d^2) scalars per client in a single post-training round) and models penultimate-layer class-conditional features as multivariate Gaussian distributions (after ReLU/tukey transformation).
Application
#r437-non-iid-cifar10-cifar100-and-cinic10-federated-calibration-application
Applied to post-training calibration of federated image classifiers (MobileNetV2, ResNet-18) on non-IID Dirichlet partitions of CIFAR-10, CIFAR-100, and CINIC-10.
⚠️ Curated Limitations & Negative Results
- Requires uploading d x d class covariance matrices (O(C d^2) floats) in the post-training calibration step.
- Calibrates only the final linear classification head while holding the feature extractor fixed.
