Child-Tuning Gradient-Masked Subnetwork Fine-Tuning
Algorithms AIMech:ChildTuningGradientMaskSubnetworkFineTuning DRAFT
Aliases: Child-Tuning, Child-Tuning_F and Child-Tuning_D, Child Network Gradient-Masked Fine-Tuning
A fine-tuning algorithm for large-scale pretrained language models that executes the forward pass across the entire pretrained network while masking out backward gradients outside a selected parameter subset (the child network) via a binary gradient mask w_{t+1} = w_t - eta * (dL(w_t)/dw_t odot M_t), where the child network is chosen either in a task-free manner by drawing M_t ~ Bernoulli(p_F) with 1/p_F unbiased gradient scaling (Child-Tuning_F) or in a task-driven manner by selecting the top-p_D fraction of parameters with the highest empirical diagonal Fisher information F^(i)(w) = (1/|D|) sum_j (d log p(y_j|x_j; w)/dw^(i))^2 prior to training (Child-Tuning_D).
Identity Notes & Concept Scope
Distinct from model pruning (which removes non-selected parameters during inference, causing severe accuracy collapse when applied to the non-child complement), from Mixout (Lee et al., ICLR 2020, which stochastically swaps parameters with pretrained weights), and from Diff-Pruning or Adapter tuning (which introduce extra trainable masks or bottleneck modules aimed at storage reduction rather than full-network forward pass with backward gradient masking).
Claims & Grounded Evidence
4 Claims
Mechanism
#r716-claim-task-free-variance
Task-free Child-Tuning_F samples a binary gradient mask M_t ~ Bernoulli(p_F) at each iteration and scales reserved gradients by 1/p_F to preserve unbiased expectation E[Delta w] = -eta dL/dw while increasing update covariance Sigma[Delta w] = (eta^2 sigma_g^2 / (p_F |B|)) I_k + ((1 - p_F) eta^2 / p_F) diag(dL/dw)^2, encouraging convergence to flatter local minima with lower sharpness rho <= O(1/sigma^2).
Mechanism
#r716-claim-task-driven-fisher
Task-driven Child-Tuning_D estimates task-specific parameter importance before fine-tuning via the empirical diagonal Fisher Information Matrix F^(i)(w) = (1/|D|) sum_{j=1}^{|D|} (d log p(y_j|x_j; w)/dw^(i))^2 on downstream labeled data D and freezes the complement of the top-p_D child network C_0 = ... = C_T to its pretrained weights w_0 throughout optimization.
Application
#r716-claim-glue-transfer-application
Across BERT_LARGE, XLNet_LARGE, RoBERTa_LARGE, and ELECTRA_LARGE on GLUE tasks (CoLA, RTE, MRPC, STS-B), Child-Tuning improves average score by 1.50 to 8.60 points over vanilla fine-tuning, boosts out-of-domain NLI transfer by up to 1.53 points and cross-task transfer by up to 7.06 points, and combines orthogonally with R3F for a +1.84 point gain on BERT_LARGE.
Limitation
#r716-claim-non-child-retention-limitation
Unlike model pruning, Child-Tuning requires retaining all non-child parameters at their pretrained values during both training and inference; zeroing out non-child parameters after Child-Tuning_D reduces average accuracy across CoLA, RTE, MRPC, and STS-B by 33.89 points and causes complete collapse (0.00 Matthews correlation) on CoLA.
⚠️ Curated Limitations & Negative Results
- Does not reduce inference parameter count or memory footprint because non-child parameters must remain present at their pretrained values during forward passes; zeroing them out drops average GLUE score by 33.89 points.
- Task-driven Child-Tuning_D requires an initial full pass over the downstream labeled dataset before training to compute empirical diagonal Fisher information for all model parameters.
