Clockwork recurrent neural network

Architectures AIMech:ClockworkRecurrentNeuralNetwork DRAFT
Aliases: CW-RNN, Clockwork RNN
A recurrent architecture partitioning hidden units into modules with prescribed update periods, copying inactive module states and restricting inter-module recurrence from slower modules to faster modules while retaining recurrence within each module.
Identity Notes & Concept Scope Compared all 442 pinned AIO and 576 native IDs, names, aliases and scoped synonyms; no normalized identity match. Ignored- and hidden-inclusive fixed-string searches of the recovery, older discovery and original Documents checkouts returned 137, 90, 89 lines. All distinct match contents were read: prior Clockwork RNN frontier entries, the new GF-RNN comparison and discovery/search context, rather than an existing Clockwork record. Semantic matching inspected 63 AIO and145 native definitions, with unchanged preceding rows verified and new matches read. Four full annotated AIO node/edge/generated contexts and four full native records were inspected. RecurrentNeuralNetwork is the broader architecture mapping. LongShortTermMemory uses a different gated memory formulation; SimpleRNNLayer is a component-level, fully connected recurrent layer rather than this modular clocked architecture; EchoStateNetwork describes reservoir/training constraints not entailed by prescribed module clocks. Fixed clock periods and copied inactive states differ from GF-RNN input-dependent pair gates, SCRN continuous decaying context, identity initialization and Zoneout stochastic state preservation. Period schedules and proposed input-buffer/phase variants do not establish separate supported concept identities here.

Claims & Grounded Evidence

Mechanism #scheduled-transition-and-topology
For module i with period T_i, the baseline updates its hidden state when t modulo T_i equals zero, using the current input and permitted previous hidden states; otherwise it retains the previous module state. Modules are internally recurrent. With modules ordered by increasing period, the recurrent matrix has an upper-triangular block structure: an active faster destination receives recurrent state from slower source modules, and slower modules do not receive faster-module state. The paper uses exponentially spaced periods in its experiments, while the general description allows other prescribed period sets.
Scope #inactive-carry-and-active-jacobian
Inactive modules copy their prior activations, and the corresponding direct state derivative is identity. The source backward-pass description copies their error contributions backward through skipped updates. Zeroed computational blocks in Equation 4 indicate which transitions are evaluated; they do not mean replacing inactive states by zero. At active steps learned recurrent matrices and nonlinearities still affect the Jacobian, so copying between ticks does not guarantee permanent gradient preservation, contraction or convergence for the complete network.
Limitation #sampling-and-input-boundaries
A slow module directly reads an input only on its update ticks and has no faster-to-slower recurrent path in this baseline. Inputs arriving between its ticks can therefore fail to affect that slow module. This does not mean the entire network ignores them, since faster modules can respond. The authors propose phase offsets, input buffers or transformations as possible responses, and discuss learning periods as future work. Those proposals are not assumed to be implemented baseline features or a general anti-aliasing guarantee.
Scope #recurrent-parameter-count
For g equally sized modules of k hidden units with the stated triangular connectivity, n=g*k and the recurrent weight count is k^2*g*(g+1)/2, giving ratio (g+1)/(2*g) relative to a fully connected n-by-n recurrence. The approximately one-half ratio is a large-g statement about recurrent weights, not an exact halving of all parameters including input/output weights or biases. Unequal module sizes require their own block counts.
Limitation #average-operation-count-and-remainder
With periods 2^i for i=0,...,g-1 and equally sized modules, the mean recurrent matrix-product count over a complete clock cycle is k^2*sum_i (g-i)/2^i. The exact finite sum equals k^2*(2*g-2+2^(1-g)); the positive final term is missing from the Appendix intermediate upper bound k^2*(2*g-2). The record uses the exact sum and does not adopt that intermediate inequality. Per-step work varies with phase, and common-multiple ticks activate every module. These recurrence counts exclude other network operations and do not certify a hardware-independent wall-clock speedup.
Limitation #conditional-evaluation-and-run-selection
The paper evaluates input-free memorization of selected audio sequences, a selected 25-word TIMIT classification task and bidirectional CTC handwriting recognition with chosen capacities, clocks and training settings. Handwriting results depend on network size: the reported small clockwork model is worse than the simple RNN, the larger one improves on it, and LSTM is better at every reported size. The first two experiments use many random initializations; the handwriting experiment uses three runs and excludes premature poor local optima before reporting averages. These comparisons do not establish universal superiority, a complete TIMIT recognizer or independently reproduced performance; no numerical benchmark is curated here.
