Federated Averaging with Server Momentum
Algorithms AIMech:FedAvgMServerMomentumFederatedAveraging DRAFT
Aliases: FedAvgM, Server Momentum Federated Averaging, Federated Averaging with Server-Side Momentum
A federated optimization algorithm (FedAvgM; Hsu, Qi, and Brown, 2019) that augments Federated Averaging with a Polyak heavy-ball momentum buffer v maintained at the central server over the sample-weighted aggregate client parameter update Delta w = sum_{k=1}^K (n_k / n) Delta w_k, updating the server velocity via v <- beta v + Delta w (with momentum factor beta in [0, 1)) and the global model via w <- w - v, coupled with a continuous Dirichlet client class-prior synthesis benchmark q ~ Dir(alpha p) parameterized by concentration alpha > 0 to evaluate and damp oscillations across non-identical client data distributions.
Identity Notes & Concept Scope
Distinct from vanilla Federated Averaging (AIMech:FederatedAveraging; McMahan et al., 2017), which corresponds to the memoryless server update beta = 0 (w <- w - Delta w). Distinct from SlowMo (AIMech:SlowMoCommunicationEfficientDistributedSgdWithSlowMomentum; Wang et al., ICLR 2020), which formulates a two-level outer-step Nesterov/heavy-ball momentum framework with explicit outer learning rate alpha and inner base optimizer steps (covering local SGD and SGP), and from FedOpt / FedAdam / FedYogi / FedAdagrad (AIMech:AdaptiveFederatedOptimization; Reddi et al., ICLR 2021), which introduce second-moment adaptive preconditioners v_t at the server. Also distinct from Mime / MimeLite (Karimireddy et al., 2020) and FedCM (Xu et al., 2021), which apply server momentum or client-level momentum inside every local client gradient step.

Mechanism
#fedavgm-server-velocity-and-effective-learning-rate-mechanism
At the end of each communication round, participating clients k = 1, ..., K return local model displacements Delta w_k = w - w_k^{(E)} obtained after E local epochs of SGD with client learning rate eta, and the server forms the sample-weighted pseudo-gradient Delta w = sum_{k=1}^K (n_k / n) Delta w_k, updates its running momentum buffer v <- beta v + Delta w, and sets w <- w - v, inducing an effective learning rate eta_eff = eta / (1 - beta) that smooths conflicting update directions across rounds of partial client participation.
Scope
#fedavgm-dirichlet-concentration-continuum-scope
To evaluate federated algorithms across a continuous spectrum of label-distribution skew, each client's class distribution q is drawn independently from a Dirichlet distribution q ~ Dir(alpha p) over prior class distribution p with concentration parameter alpha > 0: as alpha -> infinity all clients have identical class distributions matching the prior p, whereas as alpha -> 0 each client holds examples from only a single randomly chosen class; at beta = 0 FedAvgM reduces identically to vanilla FedAvg.
Limitation
#fedavgm-hyperparameter-scaling-sensitivity-and-extreme-skew-limitation
Because server momentum amplifies the effective step size by 1 / (1 - beta) (e.g., 10x at beta = 0.9), FedAvgM is sensitive to the joint tuning of client learning rate eta and beta and becomes unstable when eta_eff is too large or when local epoch count E is small (E = 1) with large reporting fraction C (Figure 4, p. 5); furthermore, under extreme single-class non-identical skew (alpha -> 0) with large local epochs, client drift still degrades accuracy relative to IID training.
Application
#fedavgm-federated-visual-classification-application
Applied to federated visual classification across Dirichlet label-skewed partitions of CIFAR-10 (CNN) and ImageNet / CIFAR benchmarks under varying client participation fractions C, local epochs E, and concentration parameters alpha in [0, 100].
⚠️ Curated Limitations & Negative Results
- Server momentum rescales the effective step size by eta_eff = eta / (1 - beta), requiring explicit down-scaling of the client learning rate eta as beta approaches 1 to prevent divergence (Section 4.2, Figures 4-5, pp. 4-5).
- Unlike variance-reduced control-variate methods (e.g., SCAFFOLD) or local momentum-tracking methods (e.g., Mime), FedAvgM applies momentum only at the server after E local epochs, so intra-round local client drift during large E on single-class clients (alpha -> 0) is not corrected during local steps (Section 4.2, Figure 4, pp. 4-5).
- Maintaining the server velocity vector v requires additional server-side state of dimension d equal to the model parameter vector.
