Gradient Masked Averaging for Federated Learning

Algorithms AIMech:FedGmaGradientMaskedAveragingForFederatedLearning DRAFT
Aliases: FedGMA, Gradient Masked Averaging, Gradient Masked FedAvg, GMA Federated Aggregation
A server-side federated aggregation algorithm (FedGMA / GMA; Tenison, Sreeramadas, Mugunthan, Oyallon, Rish, and Belilovsky, TMLR 2023) that replaces sign-agnostic parameter averaging with an elementwise soft agreement mask over client multi-step pseudo-gradient updates. At communication round t, after each participating client n in C performs K local gradient steps from w_{t-1} to produce sample-weighted update Delta_t^n = (s_n / sum_{k in C} s_k)(w_t^n - w_{t-1}) and aggregate update Delta_t = sum_{n in C} Delta_t^n, the server computes for each coordinate j the directional agreement score A_j = |(1 / |C|) sum_{n in C} sign(Delta_{t,j}^n)| in [0, 1] and applies the soft mask [m_tilde_tau]_j = 1 if A_j >= tau else A_j (with threshold tau in [0, 1]) to update w_t = w_{t-1} + eta_g (m_tilde_tau odot Delta_t).
Identity Notes & Concept Scope Distinct from centralized sample-level hard binary AND-Mask (Parascandolo et al., 2020) and SAND-Mask (Shahtalebi et al., 2021), which mask single-step sample or environment gradients with hard zeroing or tanh-based magnitude scaling in centralized training; FedGMA operates at the federated server aggregation stage across client multi-step pseudo-gradients Delta_t^n and uses a piecewise-linear soft agreement mask [m_tilde_tau]_j = 1 if A_j >= tau else A_j compatible with non-adaptive (FedAvg, FedProx) and adaptive (FedAdam, FedYogi) server optimizers. Distinct from FedAvg (AIMech:FederatedAveraging), which corresponds to the unmasked degenerate limit tau = 0 where m_tilde_0 = 1.

Mechanism #fedgma-soft-sign-agreement-mask-mechanism
At each server communication round t, FedGMA computes the coordinate-wise sign agreement score A_j = |(1 / |C|) sum_{n in C} sign(Delta_{t,j}^n)| across participating client updates Delta_t^n and constructs the soft mask [m_tilde_tau]_j = 1 when A_j >= tau and [m_tilde_tau]_j = A_j when A_j < tau, updating the global parameters via w_t = w_{t-1} + eta_g (m_tilde_tau odot Delta_t) (or applying m_tilde_tau odot Delta_t to the adaptive server step z_t / (sqrt(v_t) + eps) in FedAdam and FedYogi) so that coordinates with cross-client directional consensus take full steps while spurious client-specific directions are attenuated.
Scope #fedgma-nonconvex-convergence-and-subgaussian-mask-stability
Under L-smoothness (Assumption 4.1), bounded gradients (Assumption 4.2), bounded local and global gradient variances sigma_{l,j}^2 and sigma_{g,j}^2 (Assumptions 4.3-4.4), and random mask coordinates with inf_{j<=d} E[m_t^j] >= alpha > 0 (Assumption 4.5), Proposition 4.8 proves that for eta_g = O(1) and eta_l < 0.001 alpha / (K L), Gradient Masked FedAvg achieves (1/T) sum_{t=0}^{T-1} ||nabla f(w_t)||^2 <= O(1 / sqrt(alpha^2 T) + 1 / (alpha^2 T)); furthermore, Proposition A.1 shows that for independent sigma-sub-Gaussian coordinate updates delta^n with (1/N) card({n | E[delta^n] > 0}) > tau, the soft mask equals 1 with probability at least 1 - O(exp(-(inf_{mu^n > 0} mu^n)^2 / sigma^2)).
Limitation #fedgma-threshold-degeneracy-and-low-participation-limitation
When the agreement threshold tau is set to 0, [m_tilde_tau]_j = 1 for all coordinates so FedGMA degenerates to naive FedAvg and underfits invariant features, whereas large tau near 1 attenuates almost all coordinates and impedes fitting; moreover, when only 2 clients participate per round (Appendix D.3 Table 5), any sign disagreement yields A_j = 0 so most parameters do not update in that round, reducing participating-client accuracy (-3.3%) despite improving non-participating client accuracy (+5.8%), and Proposition 4.8's theoretical analysis relies on an independent Bernoulli mask simplification rather than the deterministic sign mask.
Application #fedgma-heterogeneous-and-ood-federated-classification-application
Applied as a drop-in server aggregation rule for FedAvg, FedProx, FedAdam, and FedYogi on label-skewed, quantity-skewed, real-world user-partitioned (FEMNIST), and spurious color-correlated out-of-distribution (FedCMNIST) image classification benchmarks (MNIST, FMNIST, CIFAR-10, CIFAR-100, TinyImageNet).
