Hyperdecoder (Encoder-Conditioned Instance-Specific Decoder Adapter Hypernetwork)

Architectures AIMech:HyperdecoderInstanceSpecificDecoderAdapter DRAFT
Aliases: Hyperdecoder, Hyperdecoders, Encoder-Conditioned Instance-Specific Decoder Adapter Hypernetwork
A parameter-efficient multi-task encoder-decoder Transformer architecture that places shared trainable parallel adapters in the frozen encoder, mean-pools the final encoder hidden states h into a two-layer ReLU MLP to form an instance embedding e = MLP(mean(h)), and feeds [e; l_i] (concatenated with a learned decoder layer embedding l_i) into a shared two-layer hypernetwork to generate unique parallel decoder adapter parameters (W_d, W_u, b_d, b_u) for every input instance and decoder layer.
Identity Notes & Concept Scope Introduced by Hamish Ivison and Matthew E. Peters (Findings of EMNLP 2022, pp. 1715-1730, arXiv:2203.08304). Distinct from HyperFormer (Karimi Mahabadi et al., ACL/IJCNLP 2021; AIMech Round 703), which generates sequential adapters for both the encoder and decoder conditioned on learned static task embeddings (producing identical parameters for all instances within a task and requiring task IDs at inference), whereas Hyperdecoder uses non-generated shared parallel adapters in the encoder and generates instance-specific parallel adapters solely in the decoder conditioned on the encoded input text without requiring task embeddings.

Mechanism #hyperdecoder-encoder-conditioned-parallel-adapter-generation-mechanism
In Hyperdecoder, each layer augments its frozen feedforward module FF with a pre-LayerNorm parallel adapter y = FF(LayerNorm(x)) + Adapter(x) where Adapter(x) = W_u(ReLU(W_d x + b_d)) + b_u (Eqs. 1-2); while encoder adapter weights are learned directly across all tasks, the decoder adapters for layer i are generated per input instance by pooling encoder hidden states h into e = MLP(mean(h)) (Eq. 8) and passing x_hyp = [e; l_i] through a shared two-layer hypernetwork h_hyp = ReLU(W_0 [e; l_i] + b_0), W_u = W_1 h_hyp + b_1, W_d = W_2 h_hyp + b_2, b_u = W_3 h_hyp + b_3, b_d = W_4 h_hyp + b_4 (Eqs. 3-7 & 9).
Scope #hyperdecoder-task-free-out-of-domain-and-parameter-count-scope
Because Hyperdecoder conditions its decoder hypernetwork on the encoded input representation e = MLP(mean(h)) rather than a learned task embedding, its total trainable parameter count l(2 a_enc d + a_enc + d) + 2 d^2 + (d + e_l) b + b(2 a_dec d + a_dec + d) (Appendix D.1 & D.3) is strictly independent of the number of tasks t and enables zero-shot out-of-domain transfer to unseen datasets without dataset-identifying task prefixes.
Application #hyperdecoder-glue-and-mrqa-multi-task-application
On multi-task GLUE with T5_large v1.1 + LM, Hyperdecoder trains 2.9% of parameters and achieves 86.5 average test score (25-run mean, reaching 86.9 in ablations), outperforming Full Finetuning (86.3 at 100% parameters), HyperFormer (71.5 at 8.8%), HyperFormer++ (76.9 at 4.6%), Task Hypernet (54.3 at 2.7%), and Modular Hypernet (84.5 at 4.8%), and on MRQA 2019 with T5_base v1.1 + LM achieves 79.5 in-domain F1 and 60.2 out-of-domain F1 (surpassing Full Finetuning at 58.8 out-of-domain F1).
Limitation #hyperdecoder-summarisation-interference-and-encoder-generation-limitation
Generating encoder adapters via either task-conditioned or input-conditioned hypernetworks degrades GLUE performance relative to directly learned encoder adapters (dropping from 86.9 to 57.9 for Task-Generated and 82.8 for Generated-Generated in Table 8), and when jointly training on combined abstractive summarisation and NLI datasets, Hyperdecoder underperforms full fine-tuning on summarisation (16.8 vs. 18.4 average R2 in Table 6) due to information compression in mean-pooling long input sequences.
