Model-free regression functionals, regressor-reweighting well-specification diagnostic, and M-of-N XY-bootstrap sandwich limit
Mathematical Methods AIMech:ModelFreeRegressionFunctionalsReweightingDiagnosticAndXYBootstrapLimit DRAFT
Aliases: Models as Approximations II model-free theory of parametric regression (Buja, Brown, Kuchibhotla, Berk, George, & Zhao 2019), Regressor-only Gaussian reweighting diagnostic trace and bootstrap tilt test for well-specification, Partial influence function IF(x_vec) = E_P[IF(Y, X_vec) | X_vec = x_vec] and Pythagorean CLT variance decomposition
A general model-free theory and diagnostic framework for parametric and penalized regression estimators viewed as statistical functionals theta(P) of the joint response-regressor distribution P = P_{Y|X_vec} (x) P_{X_vec} on arbitrary measurable spaces (Buja, Brown, Kuchibhotla, Berk, George, & Zhao 2019). Encompassing optimization functionals theta(P) = argmin_theta E_P[L(theta; Y, X_vec)] (including maximum likelihood KL-divergence functionals, proper scoring rule Bregman-divergence functionals such as the Basu-Harris-Hjort-Jones density power divergence S_alpha with Fisher consistency and redescending influence functions for alpha > 0, and penalized functionals) and estimating-equation (EE) functionals solving E_P[psi(theta; Y, X_vec)] = 0 (Section 2, Equations 1-7, Appendix A.2), the framework defines theta(.) to be well-specified for P_{Y|X_vec} iff theta(P_{Y|X_vec} (x) P_{X_vec}) = theta(P_{Y|X_vec} (x) P'_{X_vec}) for all acceptable regressor distributions P_{X_vec}, P'_{X_vec} (Section 3.1, Propositions 3.3.1-3.3.3). Because regressor-only reweighting P^w(dy, dx_vec) = w(x_vec) P(dy, dx_vec) with E_P[w(X_vec)] = 1 preserves P^w_{Y|X_vec} = P_{Y|X_vec} (Lemma 4.1), any well-specified functional satisfies theta(P^w) = theta(P) (Proposition 4.1), motivating the one-parameter Gaussian reweighting diagnostic trace xi |-> theta_hat_xi = theta(w_hat_xi(Z) P_hat) across interior deciles xi_(1) < ... < xi_(K) of a reweighting variable Z = f(X_vec) and the two-point bootstrap tilt test statistic d = theta_hat_{xi_(K)} - theta_hat_{xi_(1)} (Sections 4-5, Equations 8-9). Conditioning on the empirical regressor distribution P_hat_{X_vec} defines the conditional parameter theta(X) = theta(P_{Y|X_vec} (x) P_hat_{X_vec}) and decomposes the Total Estimation Offset theta_hat - theta(P) into the Noise Estimation Offset theta_hat - theta(X) and Approximation Estimation Offset theta(X) - theta(P) (Section 6, Propositions 6.4-6.5), governed by the full influence function IF(Y, X_vec) and partial influence function IF(x_vec) = E_P[IF(Y, X_vec) | X_vec = x_vec] (Equations 10-11, Lemma 6.6), which vanishes iff theta(.) is well-specified (Proposition 6.6) and yields the orthogonal Pythagorean CLT variance split V_P[IF(Y, X_vec)] = E_P[V_P[IF(Y, X_vec) | X_vec]] + V_P[IF(X_vec)] (Section 7, Corollary 7.1) and the exact M-of-N XY-bootstrap sandwich limit M^{1/2}(theta^*_M - theta_hat_N) ->^D N(0, AV[P_hat_N; theta(.)]) as M -> infty for fixed N (Section 8, Proposition 8.1, Corollary 8.1).

#proper-scoring-and-estimating-equation-regression-functionals-and-well-specification
Given a joint response-regressor distribution P_{Y, X_vec} = P_{Y|X_vec} (x) P_{X_vec} on measurable spaces X, Y (Section 2.1, Equation 1), regression functionals are defined via optimization theta(P) = argmin_{theta in Theta} E_P[L(theta; Y, X_vec)] (Section 2.2, Equation 2)—including maximum-likelihood functionals minimizing KL divergence with L(theta; y, x_vec) = -log q(y|x_vec; theta) (Equation 3), proper scoring (PS) functionals minimizing Bregman divergences D(P, Q) = E_P[S(Y, Q)] - H(P) such as the Basu-Harris-Hjort-Jones (BHHJ) density power divergence family S_alpha(y, Q) = -q^alpha(y)/alpha + int q^{1+alpha} dmu / (1+alpha) for alpha != 0, -1 that satisfy Fisher consistency theta(Q_{Y|X_vec; theta_0} (x) P_{X_vec}) = theta_0 and exhibit redescending influence functions for alpha > 0 (Equation 4, Appendix A.2, pages 31-33), and penalized functionals L_tilde = L + lambda R (Equation 5)—or via estimating equations E_P[psi(theta; Y, X_vec)] = 0 (Equation 6). Section 3 (pages 7-11, Propositions 3.3.1-3.3.3, Appendix A.4, pages 34-35) defines theta(.) to be well-specified for P_{Y|X_vec} iff theta(P_{Y|X_vec} (x) P_{X_vec}) = theta(P_{Y|X_vec} (x) P'_{X_vec}) for all acceptable regressor distributions P_{X_vec}, P'_{X_vec}, and proves for EE functionals (Proposition 3.3.3) that theta(.) is well-specified with value theta_0 iff E_P[psi(theta_0; Y, X_vec) | X_vec = x_vec] = 0 for all x_vec in X.
Mechanism
#regressor-only-reweighting-invariance-and-gaussian-decile-tilt-diagnostic
Reweighting the joint distribution strictly by the regressors P^w_{Y, X_vec}(dy, dx_vec) = w(x_vec) P_{Y, X_vec}(dy, dx_vec) with w(x_vec) > 0 and E_P[w(X_vec)] = 1 preserves the conditional distribution P^w_{Y|X_vec} = P_{Y|X_vec} while changing the marginal regressor distribution to P^w_{X_vec}(dx_vec) = w(x_vec) P_{X_vec}(dx_vec) (Section 4.1, page 12, Lemma 4.1, Equation 8), so any functional theta(.) well-specified for P_{Y|X_vec} satisfies theta(P^w_{Y, X_vec}) = theta(P_{Y, X_vec}) (Proposition 4.1). Sections 4.2-4.5 and Section 5 (pages 12-19, Equation 9) construct a one-parameter family of Gaussian reweighting kernels w_hat_xi(z_i) propto exp(-(z_i - xi)^2 / (2 gamma^2)) normalized to 1/N sum_{i=1}^N w_i = 1 with bandwidth gamma = alpha sigma_hat(Z) along a univariate reweighting feature Z = f(X_vec) evaluated at interior sample deciles xi_(1) < ... < xi_(K) (K = 9), plotting the empirical parameter trace xi |-> theta_hat_xi = theta(w_hat_xi(Z) P_hat) against bootstrap spaghetti bands and testing well-specification via the two-point tilt test statistic d = theta_hat_{xi_(K)} - theta_hat_{xi_(1)}.

Conditioning on the empirical regressor distribution P_hat_{X_vec} = 1/N sum_{i=1}^N delta_{X_vec_i} defines the conditional parameter theta(X) = theta(P_{Y|X_vec} (x) P_hat_{X_vec}) and decomposes the Total Estimation Offset theta_hat - theta(P) = [theta_hat - theta(X)] + [theta(X) - theta(P)] into the Noise Estimation Offset (which vanishes identically when Y = f(X_vec) is deterministic, Proposition 6.5) and the Approximation Estimation Offset (which vanishes for all acceptable X iff theta(.) is well-specified, Proposition 6.4 and Corollary 6.4, pages 20-22). Defining the full influence function IF(y, x_vec) (Equation 10) and the partial influence function with respect to P_{X_vec}, IF(x_vec) = d/dt|_{t=0} theta(P_{Y|X_vec} (x) ((1-t)P_{X_vec} + t delta_{x_vec})) = E_P[IF(Y, X_vec) | X_vec = x_vec] (Equation 11, Lemma 6.6, page 22), Proposition 6.6 (proved in Appendix A.3, pages 33-34) proves that theta(.) is well-specified for P_{Y|X_vec} iff IF(x_vec) = 0 for all x_vec, and Section 7.1 (pages 23-24, Corollary 7.1) establishes the asymptotically orthogonal CLT decomposition N^{1/2}(theta_hat - theta(X)) = N^{-1/2} sum_{i=1}^N (IF(Y_i, X_vec_i) - IF(X_vec_i)) + o_P(1) and N^{1/2}(theta(X) - theta(P)) = N^{-1/2} sum_{i=1}^N IF(X_vec_i) + o_P(1) with Pythagorean asymptotic covariance split V_P[IF(Y, X_vec)] = E_P[V_P[IF(Y, X_vec) | X_vec]] + V_P[E_P[IF(Y, X_vec) | X_vec]].
Mechanism
#frechet-differentiable-functional-m-of-n-xy-bootstrap-sandwich-limit
Section 8 (pages 25-26, Proposition 8.1 and Corollary 8.1, proved in Appendix A.5, page 35) proves that for any regression functional theta(.) that is continuously Fréchet differentiable at a fixed empirical distribution P_hat_N with influence function IF_{P_hat_N}(y, x_vec) and non-singular empirical sandwich covariance matrix AV[P_hat_N; theta(.)] = V_{P_hat_N}[IF_{P_hat_N}(Y, X_vec)], drawing M bootstrap observations (Y^*_j, X_vec^*_j)_{j=1}^M i.i.d. from P_hat_N yields the M-of-N XY-bootstrap estimator theta^*_M = theta(P^*_M) satisfying M^{1/2}(theta^*_M - theta_hat_N) ->^D N(0, AV[P_hat_N; theta(.)]) as M -> infty for fixed N, so that the empirical Huber sandwich covariance estimator Lambda_hat^{-1} V_{P_hat_N}[psi(theta_hat_N; Y, X_vec)] (Lambda_hat')^{-1} is the exact infinite-M limit of M-of-N XY-bootstrap variance estimation.
⚠️ Curated Limitations & Negative Results
- Invariance of a regression functional across a chosen one-parameter reweighting family w_xi(Z) for a specific reweighting feature Z = f(X_vec) is necessary but not sufficient for global well-specification across all acceptable regressor distributions P'_{X_vec}, because misspecification orthogonal to Z or cancelling across the chosen weights may remain undetected (Section 4.3, pages 13-14).
- Aggressive reweighting in the tails of the regressor distribution reduces the effective sample size and inflates the variance of theta_hat_xi, which is why the diagnostic restricts reweighting centers xi_(1) < ... < xi_(K) to interior deciles and pairs the trace with bootstrap spaghetti bands (Sections 4.2-4.5, pages 12-15).
- Six minor typographical notes in arXiv:1612.03257v2 were identified and verified during full-text inspection: (1) Section 1 (page 4, line 23) prints 'boostrap estimators' for 'bootstrap estimators'; (2) the Section 2.2 heading (page 6) prints 'EE Funtionals' for 'EE Functionals'; (3) Section 6.2 (page 21, second display box) prints 'E_P[psi(theta Y, X_vec)] = 0' missing the semicolon after theta; (4) Section 7.1 (page 24, line 11) prints 'IF(Y, X_vec) - E_P[IF(Y, |X_vec)' missing the second X_vec and closing bracket; (5) Section 8.1 Footnote 10 (page 25) prints 'at M grows' for 'as M grows'; and (6) Appendix A.3 (page 34, line 5) prints 'is a shown in Proposition 6.6' and Appendix A.4 heading prints 'Proof of Lemma 3.3.3' when proving Proposition 3.3.3.
