Prototypical Calibration for Few-Shot Language Models
Algorithms AIMech:PrototypicalCalibrationForFewShotLanguageModels DRAFT
Aliases: PROCA, Prototypical Calibration, GMM-Based Prototypical Decision Boundary Calibration
A decision-boundary calibration algorithm for zero- and few-shot language model classification (PROCA) that models the N-dimensional log-probability output vectors over an unlabeled in-domain estimate set as an N-component Gaussian Mixture Model estimated via Expectation-Maximization, aligns the learned prototypical Gaussian clusters to the N target categories by solving a maximum-weight bipartite matching problem on the cluster mean coordinates, selects the highest-scoring EM run, and classifies test inputs by assigning them to the cluster with maximum Gaussian density while discarding mixture weights.
Identity Notes & Concept Scope
Distinct from Contextual Calibration (AIMech:CalibrateBeforeUseContextualCalibration) and Domain-Conditional PMI (AIMech:PMIDCDomainConditionalPointwiseMutualInformation), which apply diagonal scaling or subtract a single content-free/domain-premise baseline probability rather than estimating full class-conditional Gaussian covariances and means over the output distribution of an unlabeled estimate set. Also distinct from Prototypical Networks in metric meta-learning, which compute Euclidean distances to labeled support-set averages in a learned encoder representation space rather than fitting an unsupervised GMM with bipartite matching over frozen language-model log-probability outputs.

Mechanism
#proca-gmm-log-probability-cluster-estimation
Given an N-way classification task, PROCA normalizes the language model's label-token logits into an N-dimensional log-probability vector x for each unlabeled example in an estimate set D_esti and estimates N prototypical Gaussian clusters P_G(X | mu_n, Sigma_n) using the Expectation-Maximization algorithm.
Mechanism
#proca-bipartite-matching-and-weights-cutting-inference
PROCA assigns the N estimated clusters to the N target labels by maximizing the Cluster-Label Assignment score CLA(e, k) = sum_{n=1}^N mu_{n, k_n} via the Kuhn-Munkres weighted bipartite matching algorithm, selects the EM run e* that maximizes CLA(e, k*(e)), and classifies each test example by argmax_n P_G(x | mu_n*, Sigma_n*) while discarding the mixture weights alpha_n to remain robust under class imbalance.
Application
#proca-zero-and-few-shot-text-classification-application
PROCA is applied to zero- and few-shot classification across GPT-2, GPT-Neo, GPT-J, and BLOOM-176B on nine text classification benchmarks (SST-2, SST-5, MR, Subj, AP, AGNews, DBPedia, RTE, and TREC), improving accuracy by an average of 13% over standard argmax decoding and 6% over Contextual Calibration while sharply reducing sensitivity to prompt templates and demonstration permutations.
Limitation
#proca-closed-label-space-limitation
PROCA requires a fixed, closed N-class label space to fit an N-component Gaussian Mixture Model and solve the N-by-N bipartite cluster-label assignment, making it inapplicable to open-ended text generation or free-form question answering.
⚠️ Curated Limitations & Negative Results
- Requires an unlabeled in-domain estimate set (sampled from unlabeled task data or generated by the language model) and forward inference over that set to fit the Gaussian Mixture Model.
- When the underlying language model's representations fail to separate classes at all on a task (such as smaller GPT-2 models on RTE), GMM clustering cannot recover discriminative boundaries.
