RocketQAv2 Joint Training for Dense Passage Retrieval and Passage Reranking
Algorithms AIMech:RocketQAv2JointTrainingDensePassageRetrievalAndReranking DRAFT
Aliases: RocketQAv2, RocketQAv2 Dynamic Listwise Distillation and Hybrid Data Augmentation, Joint Training Method for Dense Passage Retrieval and Passage Reranking
A joint training algorithm for dense passage retrieval and passage reranking that couples a bi-encoder dual-encoder retriever s_de(q, p) = E_Q(q)^T E_P(p) and a cross-encoder reranker s_ce(q, p) = w^T E_C([CLS] q [SEP] p [SEP]) over a shared candidate passage list C_q = {p^+, p^-_1, ..., p^-_{K-1}} via dynamic listwise distillation and hybrid data augmentation: it normalizes both models' listwise relevance scores via softmax (p~_de(q, p_i) = exp(s_de(q, p_i)) / sum_{j=1}^K exp(s_de(q, p_j)) and p~_ce(q, p_i) = exp(s_ce(q, p_i)) / sum_{j=1}^K exp(s_ce(q, p_j))), jointly minimizes the sum of the listwise Kullback-Leibler divergence and cross-encoder supervised NLL loss L_final = L_kl + L_ce where L_kl = sum_{i=1}^K p~_ce(q, p_i) log(p~_ce(q, p_i) / p~_de(q, p_i)) and L_ce = -log p~_ce(q, p^+), and refreshes C_q using a hybrid data augmentation strategy that retrieves top candidates with the dual-encoder and filters out high-confidence false negatives using the cross-encoder.
Identity Notes & Concept Scope
Distinct from RocketQA (AIMech:RocketQADenoisedHardNegativeSampling), which alternates separate training stages of the retriever and reranker with static pseudo-labels rather than joint synchronous dynamic listwise distillation; distinct from TAS-B (AIMech:TASBTopicAwareSamplingBalancedMarginDistillation), which distills pairwise score margins from static teacher models using topic-clustered batches; and distinct from AR2 (AIMech:AR2AdversarialRetrieverRankerForDenseTextRetrieval), which formulates retriever-ranker training as a minimax adversarial game rather than mutual listwise KL alignment.
Claims & Grounded Evidence

Mechanism
#rocketqav2-dynamic-listwise-kl-distillation
RocketQAv2 normalizes dual-encoder and cross-encoder relevance scores across the candidate passage list C_q = {p^+, p^-_1, ..., p^-_{K-1}} using listwise softmax distributions p~_de(q, p_i) and p~_ce(q, p_i) (Equations 5-6) and jointly optimizes L_final = L_kl + L_ce where L_kl = sum_{i=1}^K p~_ce(q, p_i) log(p~_ce(q, p_i) / p~_de(q, p_i)) and L_ce = -log p~_ce(q, p^+) (Equations 7-8), allowing the dual-encoder to track continuous listwise score changes of the cross-encoder online during training.
Mechanism
#rocketqav2-hybrid-data-augmentation
To construct high-quality candidate lists C_q for joint training and iterative refinement, RocketQAv2 applies hybrid data augmentation (Section 2.3, Figure 1b) that combines dual-encoder hard-negative retrieval with cross-encoder denoising to filter out false negatives (unlabeled relevant passages) while retaining informative hard negatives.
Application
#rocketqav2-benchmark-applications
On MS MARCO Passage Ranking and Natural Questions (NQ), RocketQAv2 improves both dense retrieval and passage reranking over RocketQA and prior methods, reaching 38.8 MRR@10 and 86.2% Recall@50 in dense retrieval on MS MARCO Dev (41.9 MRR@10 after reranking) and 75.1% Recall@5 / 83.7% Recall@20 on NQ test (Tables 1-2).
Limitation
#rocketqav2-computational-overhead-limitation
Because RocketQAv2 evaluates both the dual-encoder and the cross-encoder on all K passages in the candidate list C_q at every joint training step and requires a warmed-up cross-encoder for initial hybrid data augmentation, its per-step GPU memory and compute cost during training is substantially higher than training a standalone dual-encoder.
⚠️ Curated Limitations & Negative Results
- Joint online forward and backward passes through both the cross-encoder reranker and the dual-encoder retriever across K candidate passages per query require large multi-GPU memory and compute budgets.
- Requires an initial cross-encoder warmup stage and corpus-wide passage indexing for hybrid data augmentation.
