SEED Pre-Training a Strong Text Encoder Using a Weak Decoder

Aliases: SEED-Encoder, SEED Weak-Decoder Pre-Training for Dense Retrieval, Pre-Training a Strong Text Encoder for Dense Retrieval Using a Weak Decoder
A representation-bottleneck encoder-decoder pre-training architecture for dense text retrieval (SEED-Encoder) that encodes a masked input passage with a deep bidirectional Transformer encoder (trained with masked language modeling) into a single dense [CLS] representation vector and feeds only that [CLS] vector—blocking all non-[CLS] token representations from the encoder—to a structurally weakened autoregressive Transformer decoder (few layers and a restricted local self-attention span k where decoding step i can attend only to the encoder [CLS] vector and at most the preceding k local tokens i-k+1..i) to reconstruct the original uncorrupted document, thereby forcing global semantic information into the encoder [CLS] embedding before discarding the weak decoder for dense retrieval fine-tuning.
Identity Notes & Concept Scope
Distinct from Condenser (AIMech:CondenserPreTrainingArchitectureForDenseRetrieval), which uses a bidirectional MLM head with late-to-early skip connections rather than an autoregressive decoder with restricted local attention span k; distinct from RetroMAE (AIMech:RetroMAERetrievalOrientedMaskedAutoEncoder) and SimLM (AIMech:SimLMRepresentationBottleneckPreTraining), which use shallow bidirectional decoders with masked or generator-replaced tokens rather than causal autoregressive decoding with restricted attention span k; and distinct from standard BART/T5 seq2seq pre-training, which passes all encoder token embeddings via cross-attention and uses a strong full-span decoder.
Claims & Grounded Evidence

Mechanism
#seed-cls-bottleneck-and-weak-decoder-span
SEED-Encoder disconnects cross-attention to non-[CLS] encoder token representations so that the decoder accesses the encoder exclusively through the dense [CLS] vector, and weakens the autoregressive decoder Along two axes—shallow depth (e.g., 1 to 3 layers) and restricted local attention span k (where position i only attends to the encoder [CLS] vector and local tokens i-k+1..i)—so the decoder cannot rely on long-range causal language modeling and must extract global passage semantics from the [CLS] vector.
Mechanism
#seed-ablation-of-decoder-strength
Ablation studies across decoder depth and attention span k (Table 4) demonstrate that overly strong decoders (unlimited attention span k = All or deeper 6-layer decoders) degrade downstream dense retrieval accuracy because the decoder solves autoregressive next-token prediction from local/causal context without forcing information through the encoder [CLS] bottleneck, whereas a 3-layer decoder with restricted span k = 2 or 3 maximizes retrieval MRR and Recall.
Application
#seed-dense-retrieval-applications
Pre-training with SEED-Encoder improves dense retrieval across both in-batch negative training and ANCE hard-negative training on MS MARCO Passage Ranking, MS MARCO Document Ranking, and Natural Questions (Tables 1-3).
Limitation
#seed-span-tuning-limitation
Setting the decoder attention span too small (k = 1, degenerating toward bag-of-words prediction) or too large (k = All, full causal attention) hurts downstream dense retrieval performance (Table 4), requiring careful tuning of decoder capacity relative to encoder size.
⚠️ Curated Limitations & Negative Results
- Downstream retrieval quality is sensitive to the balance of decoder weakness (attention span k and number of decoder layers); both k=1 and unrestricted causal attention underperform k=2..3.
- Adds an auxiliary autoregressive decoder during pre-training before discarding it for fine-tuning.
