SPARTA Sparse Transformer Matching for Retrieval

Architectures AIMech:SPARTASparseTransformerMatchingForRetrieval DRAFT
Aliases: SPARTA, Sparse Transformer Matching, SPARTA Neural Ranker, SPARTA: Efficient Open-Domain Question Answering via Sparse Transformer Matching Retrieval
A sparse neural retrieval architecture for open-domain and sentence-level question answering that encodes each query q = [t_1, ..., t_|q|] via non-contextualized word embeddings E(q) = [e_1, ..., e_|q|] and each candidate answer with surrounding context (a, c) = [c_1, ..., a_1, ..., a_|a|, c_{a+1}, ..., c_|c|] (distinguished by BERT segment embeddings 1 and 0) via a bidirectional Transformer encoder H(a, c) = [s_1, ..., s_|c|], scores each query token via max-pooled token-level dot-product interaction y_i = max_{j in [1, |c|]}(e_i^T s_j), enforces sparsity and scale regularization through a biased ReLU and logarithm f(q, (a, c)) = sum_{i=1}^{|q|} log(ReLU(y_i + b) + 1), trains end-to-end with a cross-entropy learning-to-rank objective over random and nearby-sentence hard negatives, and precomputes LOOKUP(t, (a, c)) = log(ReLU(max_j(e_t^T s_j) + b) + 1) offline for every vocabulary term t in V to store human-interpretable sparse answer vectors in a standard Inverted Index for O(1) lookup and summation at query time.
Identity Notes & Concept Scope Distinct from SPLADE (AIMech:SPLADESparseLexicalAndExpansionModel), which uses the Masked Language Modeling output head on contextualized query and document encoders with explicit L1/FLOPS sparsity regularization rather than non-contextualized query word embeddings max-pooled against contextualized answer+context BERT tokens with a scalar ReLU threshold b; and distinct from COIL (AIMech:COILContextualizedInvertedList) and DeepCT (AIMech:DeepCTContextAwareTermImportanceEstimationForFirstStageRetrieval), which restrict index entries to exact tokens appearing in the document rather than scoring and indexing latent non-appearing vocabulary terms (such as question words 'who', 'where', and synonyms).

Claims & Grounded Evidence

Mechanism #sparta-token-level-max-pooling-and-log-relu-sparsity-control
SPARTA encodes answer sentences a and their surrounding context c using BERT with segment_id = 1 for answer tokens and segment_id = 0 for context tokens into H(a, c) = [s_1, ..., s_|c|] while embedding query tokens via non-contextualized BERT word embeddings E(q) = [e_1, ..., e_|q|] (Equations 2-3), computing token-level max-pooling y_i = max_{j in [1, |c|]}(e_i^T s_j) (Equation 4), sparse thresholding phi(y_i) = ReLU(y_i + b) with trainable bias b (Equation 5), and log-regularized aggregation f(q, (a, c)) = sum_i log(phi(y_i) + 1) (Equation 6), and training with cross-entropy loss J = f(q, (a+, c+)) - log sum_{k in K-} exp(f(q, (a_k, c_k))) using 50% random negatives and 50% nearby-sentence negatives from the ground-truth passage (Equation 7).
Mechanism #sparta-offline-vocabulary-lookup-and-inverted-index-inference
Because query token embeddings e_t are non-contextual, SPARTA precomputes LOOKUP(t, (a, c)) = log(ReLU(max_j(e_t^T s_j) + b) + 1) for every term t in the vocabulary V against every candidate answer at indexing time (Equation 8, producing ~1600 non-zero terms per sentence including latent question words and synonyms such as 'who' or 'utah' not literally present in the text, Table 6) and stores them in a Lucene Inverted Index so inference reduces to O(1) term lookup plus summation f(q, (a, c)) = sum_{i=1}^{|q|} LOOKUP(t_i, (a, c)) without GPU or ANN search (Equation 9, Figure 1(b)).
Application #sparta-openqa-and-multireqa-out-of-domain-generalization-application
SPARTA achieves 59.3 EM / 66.5 F1 on OpenSQuAD, 37.5 Test EM on OpenNQ, 62.9 EM / 79.9 F1 on OpenCMRC, and 63.1 EM / 74.6 F1 on OpenDRCD (Tables 1-2), outperforms BM25 by 114.3%, USE-QA by 50.6%, and Poly-Encoders by 26.5% in average in-domain MRR across 5 ReQA datasets (Table 4), and retains strong performance when pruned to only the top-50 or top-500 non-zero terms per answer vector (achieving 69.5 MRR on SQuAD at top-50 with 1.6% of Poly-Encoder's memory footprint, Table 7).
Limitation #sparta-bag-of-words-query-and-single-hop-limitation
To enable offline vocabulary-wide inverted-index precomputation, SPARTA restricts query representations to non-contextualized bag-of-words embeddings that discard word-order information in the query (Section 3.2, Section 5.1 & Section 7), and its single-stage ranker does not natively support multi-hop reasoning across multiple evidence passages (Section 7).
